The Challenge
Building an AI model is only one part of delivering a reliable AI product.
The primary challenge was transforming computationally intensive audio-processing models into a scalable SaaS platform that could provide consistent results without compromising performance, reliability, or user experience.
1. Closing the Gap Between AI Research and Production
Raw audio separation models can produce unwanted artifacts such as metallic sounds, phase cancellation, high-frequency distortion, and other audible imperfections.
A production platform required more than simply running an AI model. The system needed intelligent preprocessing, multi-stage inference, post-processing, normalization, and quality control.
2. Handling GPU-Intensive Workloads
Audio separation and neural voice restoration require significant CPU, RAM, and GPU resources.
Running these workloads directly inside the web application could block application processes, increase infrastructure costs, and create stability issues under concurrent workloads.
The solution required a dedicated inference architecture capable of processing jobs independently from the main application.
3. Building Reliable Background Processing
Audio processing is inherently asynchronous. Users submit a file, but the result may require significant computation before it becomes available.
A reliable job-processing system was required to prevent duplicate processing, database contention, stalled jobs, and lost workloads when workers failed.
4. Creating Transparent Usage-Based Billing
The platform required a billing model that did not depend exclusively on recurring subscriptions.
Users needed transparent credits that could be purchased, consumed, refunded when processing failed, and used consistently across both the web application and developer API.
Our Solution
We designed and engineered StemForge as a decoupled cloud-native platform separating the user-facing application, orchestration layer, database, job queue, AI inference infrastructure, and object storage.
This architecture allowed each component to scale independently while keeping the core application responsive.
High-Level Architecture
User Interface → API & Orchestration → Job Queue → GPU AI Workers → Object Storage → Processed Results
The application layer handles authentication, uploads, API requests, billing, and job creation.
The background processing layer manages job execution and worker coordination.
Dedicated Python/PyTorch workers perform the computationally intensive AI inference.
Object storage handles large source files and generated audio outputs without placing unnecessary load on the application servers.
AI Processing Architecture
One of the key engineering decisions was to avoid relying on a single AI model for every audio-processing task.
Instead, we implemented specialized processing pipelines for different requirements.
Multi-Stem Music Separation
StemForge supports multiple levels of separation:
2-Stem: Vocals and Instrumental
4-Stem: Vocals, Drums, Bass, and Other
6-Stem: Expanded separation including Guitar and Piano
This gives users flexibility depending on the quality, processing time, and level of control required for their workflow.
Neural Voice Restoration
For speech cleanup, we developed a sequential four-stage processing pipeline.
Stage 1 — Noise Reduction
DeepFilterNet3 removes environmental noise such as HVAC systems, fans, computer noise, and other continuous background sounds.
Stage 2 — De-Reverberation
BSRNN / UVR-based processing reduces room reflections, echo, and unwanted acoustic characteristics.
Stage 3 — Background Audio Removal
Meta Demucs v4 isolates speech from background music and other audio sources.
Stage 4 — Speech Restoration
VoiceFixer reconstructs missing frequency information and improves recordings affected by compression, clipping, or low-quality microphones.
This multi-stage approach enabled StemForge to address different audio degradation problems independently rather than depending on one generalized model.
Audio Post-Processing
AI inference was followed by a dedicated audio enhancement layer to improve the usability of generated stems.
The processing pipeline included:
DC offset removal
High-pass filtering
Phase artifact suppression
Spectral noise reduction
Noise gating
LUFS loudness normalization
BPM detection
Musical key detection
The result was a processing pipeline designed not only to generate separated audio but also to produce files that are more practical for professional editing and production workflows.
Scalable Job Processing
A major architectural challenge was designing reliable background processing without introducing unnecessary infrastructure complexity.
Instead of immediately introducing external message brokers, we implemented a PostgreSQL-based job queue using:
FOR UPDATE SKIP LOCKED
This allowed multiple workers to safely claim pending jobs concurrently without waiting on one another.
Job Lifecycle
Pending → Processing → Completed
Workers also maintained heartbeats so that failed or disconnected workers could be detected.
Jobs that exceeded their processing window could be returned to the queue, while persistent failures were routed through dead-letter handling.
This architecture provided a lightweight but reliable foundation for concurrent AI processing.
Secure and Flexible File Processing
Large audio files were never required to pass unnecessarily through the application server.
We implemented presigned upload and download workflows using an abstraction layer around object storage.
The architecture supports:
AWS S3 in production
MinIO for local development
Presigned uploads
Presigned downloads
Isolated job-specific storage
Cloud-provider flexibility
This approach reduces application-server bandwidth requirements while making the storage layer easier to migrate or replace.
Credit Ledger & Developer API
StemForge also required a reliable consumption and billing architecture.
We implemented an immutable credit ledger based on transaction events rather than directly modifying a user's balance.
Transactions included:
Signup credits
Credit purchases
Provisional debits
Completed jobs
Refunds
When a user submits a job, credits are provisionally reserved.
If processing succeeds, the transaction is finalized.
If processing fails, the reserved credits are automatically returned.
This approach creates a more reliable audit trail and prevents billing inconsistencies caused by failed processing jobs.
Developer API
The same credit system powers the platform's developer API.
Developers can generate API keys and submit audio-processing jobs programmatically without requiring a separate billing system.
This allows the platform to support both:
Interactive SaaS users and API-driven integrations
through the same underlying infrastructure.
Engineering Quality
Production reliability was treated as a core requirement rather than an afterthought.
Strict Type Safety
The TypeScript codebase was configured with strict compiler settings, including:
strict: truenoUncheckedIndexedAccess: trueZero intentional
anyusage
Service Abstractions
Critical infrastructure components were isolated behind dedicated services.
StorageService
Abstracts S3/MinIO operations so that storage providers can be changed without rewriting application business logic.
QueueService
Encapsulates job orchestration and keeps queue implementation separate from API functionality.
Validation & Security
Runtime validation was implemented using Zod for:
API request payloads
Environment variables
Application configuration
Sensitive credentials were kept outside application source code through environment-based configuration.
Automated Testing
The platform included:
Unit testing with Vitest
End-to-end testing with Playwright
TypeScript compiler validation
ESLint static analysis
This created a repeatable verification process across application and infrastructure changes.
Results & Impact
The resulting platform achieved strong performance and reliability benchmarks.
Metric | Result |
|---|---|
Real-Time Factor | < 0.25 on GPU workers |
3.5-Minute Audio Processing | Under 45 seconds |
PESQ Speech Quality | > 3.8 / 4.5 |
STOI Intelligibility | > 0.92 / 1.00 |
Processing Success Rate | 99.95% |
Cloud Flexibility | Cloud-agnostic architecture |
These results demonstrate that the platform could combine sophisticated AI inference with production-grade application engineering.
Business Impact
The engineering work delivered more than an AI model integration.
StemForge became a complete product platform with the infrastructure required to support real users, developers, and future product expansion.
Faster Processing
GPU-based inference and asynchronous job processing enabled significantly faster audio workflows while keeping the web application responsive.
Improved Audio Quality
The multi-stage AI pipeline and post-processing layer addressed multiple sources of degradation instead of relying on a single separation model.
Greater Infrastructure Flexibility
Storage and processing components were abstracted to reduce dependency on a single infrastructure provider.
Reliable Usage Billing
